Machine Learning-Based Methods#
Machine learning-based methods in sentiment analysis leverage algorithms and models to predict sentiments in text data. These methods can be divided into supervised learning and unsupervised learning approaches.
Supervised and Unsupervised Methods#
Sentiment analysis can be performed using both supervised and unsupervised methods.
Supervised Learning#
In supervised learning methods, a model is trained using a labeled dataset, where each document has a known sentiment label. The goal is to learn a mapping between the input features (e.g., text data) and output labels (e.g., positive or negative sentiment). Some popular supervised learning algorithms include:
Logistic Regression: A linear model that estimates the probability of a given document belonging to a specific class (e.g., positive or negative sentiment). Logistic regression works well when there is a linear relationship between the input features and the output labels.
Support Vector Machines (SVM): A non-linear model that aims to find the best hyperplane separating the data points of different classes. SVMs are particularly suitable for high-dimensional data and can be used with different kernel functions to capture complex relationships between the features and labels.
Deep Learning: Neural networks, such as Convolutional Neural Networks (CNN) and Recurrent Neural Networks (RNN), can automatically learn complex features and representations from raw text data. These models have shown significant success in various natural language processing tasks, including sentiment analysis.
Example: Training a logistic regression model for sentiment analysis using a labeled dataset of movie reviews. The input features could be the term frequency-inverse document frequency (TF-IDF) representations of the reviews, and the output labels would be positive or negative sentiment.
Unsupervised Learning Techniques#
Unsupervised learning techniques aim to analyze text data and infer sentiment without relying on labeled training examples. These methods typically involve clustering, dimensionality reduction, or topic modeling to identify patterns and relationships within the text.

Clustering#
Clustering is an unsupervised learning technique that groups similar data points based on their features. In the context of sentiment analysis, clustering can be used to identify groups of texts with similar sentiment. Popular clustering algorithms like K-means, DBSCAN, and Hierarchical Clustering can be applied to text data after converting them into numerical representations using methods like Bag-of-Words or TF-IDF.
The main challenge with clustering techniques for sentiment analysis is determining the optimal number of clusters and interpreting the sentiment of each cluster. Moreover, clustering algorithms may struggle to capture the complex relationships between words and sentiments due to the high dimensionality and sparsity of text data.
Dimensionality Reduction#
Dimensionality reduction techniques aim to represent high-dimensional data in a lower-dimensional space while preserving the relevant information. In sentiment analysis, dimensionality reduction can help visualize and interpret text data by revealing underlying sentiment structures. Techniques like Principal Component Analysis (PCA), t-Distributed Stochastic Neighbor Embedding (t-SNE), and Uniform Manifold Approximation and Projection (UMAP) can be applied to text data after converting them into numerical representations.
Dimensionality reduction can provide valuable insights into the relationships between texts and sentiments, but it does not inherently produce sentiment labels or scores. Moreover, some dimensionality reduction techniques, like t-SNE, are computationally expensive and may not scale well to large datasets.
Topic Modeling#
Topic modeling is an unsupervised learning technique used to discover latent topics in a collection of documents. Algorithms like Latent Dirichlet Allocation (LDA) and Non-negative Matrix Factorization (NMF) can identify groups of words that frequently co-occur in the documents, representing underlying topics. In the context of sentiment analysis, topic modeling can be used to identify topics that are indicative of positive or negative sentiment.
Example: Using LDA to identify sentiment-related topics in a collection of product reviews. The discovered topics might correspond to different aspects of the products, such as quality, price, and customer service. Sentiment labels can be inferred based on the dominant words or phrases within each topic.
However, using topic modeling for sentiment analysis presents some challenges. Firstly, the number of topics must be determined a priori, and it may not directly correspond to the number of sentiment classes. Secondly, the topics discovered by topic modeling algorithms are not guaranteed to be sentiment-related, and additional analysis may be required to interpret their sentiment relevance.
Traditional Machine Learning Techniques#

Feature Engineering#

Bag-of-Words (BoW) Representation: In the BoW model, a document is represented as a “bag” (unordered set) of its words, disregarding grammar and word order but keeping track of the frequency of each word. BoW representation can be extended with term frequency-inverse document frequency (TF-IDF) weighting, which highlights the importance of specific words in the context of the entire corpus.
N-grams: N-grams are contiguous sequences of n words from a given text. Using n-grams as features can help capture local context and word order information. For example, bigrams (n=2) can capture pairs of adjacent words, which may carry more sentiment information than individual words.
Part-of-Speech (POS) Tagging: POS tags provide grammatical information about the words in the text, which can be useful in sentiment analysis. For example, adjectives and adverbs are more likely to carry sentiment information than other parts of speech.
Sentiment Lexicons: Incorporating sentiment lexicons, such as SentiWordNet or the MPQA Subjectivity Lexicon, can enhance the feature set with domain-specific sentiment information. These lexicons provide sentiment scores for words, which can be aggregated to generate features for a document.
Popular Traditional Machine Learning Algorithms#
Various traditional machine learning algorithms have been employed for sentiment analysis tasks, including:

Deep Learning Techniques#
Deep learning techniques have revolutionized sentiment analysis by providing powerful models that can automatically learn relevant features from raw text data. These techniques usually involve neural networks with various architectures, which can learn hierarchical representations of text data without the need for manual feature engineering.
Word Embeddings#
Before diving into deep learning architectures, it’s essential to mention word embeddings, which are dense vector representations of words that capture semantic and syntactic information. Pre-trained word embeddings like Word2Vec, GloVe, and FastText can be used as input features for deep learning models, enabling them to generalize better and work with large vocabularies. More recent contextualized word embeddings like BERT, GPT, and ELMo provide even more powerful representations by considering the context of each word in a sentence.
Recurrent Neural Networks (RNN)#
Recurrent Neural Networks (RNNs) are a class of neural networks designed to work with sequential data, making them suitable for sentiment analysis tasks involving text.
